Why Most Prototype AI Agents Fail in Production
Building a viral Twitter demo of an AI agent takes an afternoon; deploying that same agent to process real bank transfers or medical records without human disaster takes months of defensive architecture.
The fundamental trap developers fall into is treating generative language models as deterministic execution engines. LLMs are probabilistic prediction networks. When an unexpected tool error or schema mismatch occurs, an unconstrained agent often begins hallucinating synthetic tool outputs to satisfy its prompt objective.
The Three Golden Rules for Agentic Systems
1. **Deterministic Guardrails**: Wrap all stochastic decisions between deterministic validation gates. If a model generates SQL, run an EXPLAIN query and verify table whitelist access before execution.
2. **Idempotent Tool Actions**: Every API exposed to an agent must be idempotent. If an agent retries an order placement after a network timeout, it must not bill the user twice.
3. **Audit Trails**: Record complete token traces, system state snapshots, and latency watermarks for every intermediate reasoning thought.
